Continual learning for AI models remains an unsolved challenge, with significant trade-offs between Supervised Fine-Tuning (SFT) and Reinforcement Learning (RL). SFT can instill new knowledge but suffers from catastrophic forgetting and degradation of general capabilities due to its off-policy nature. RL, while more on-policy, is limited to upweighting existing sampled behaviors and struggles to integrate entirely new knowledge. Distillation can provide a warm start for RL, leading to higher initial performance but potentially plateauing at a lower overall capability than RL alone. Optimizing the ratio of SFT and distillation to RL is crucial for specific tasks, especially for narrow applications versus general-purpose agents. Frontier labs are actively working on this loop, albeit slowly.
