Implement robust k-means with k-means++ initialization
Problem Description
Implement, from scratch in Python and without using external machine learning libraries like scikit-learn, a kmeans function with the signature kmeans(X, k, max_iter=300, tol=1e-4, random_state=0) that returns (centroids, labels).
Requirements
- Initialization: Utilize the k-means++ algorithm for initial centroid selection.
- Performance: Employ vectorized NumPy operations for efficient distance computations.
- Convergence: Implement an early stopping mechanism when the maximum centroid shift between iterations falls below a specified tolerance (
tol). - Robustness: Gracefully handle empty clusters by re-seeding them. The re-seeding strategy should involve selecting a new centroid from the data point that is furthest from its current cluster centroid (i.e., has the largest assignment distance).
- Flexibility: Support an optional
sample_weightsarray. If provided, these weights must be applied during both the assignment step (determining which cluster a point belongs to) and the centroid update step (calculating new centroid positions). - Reproducibility: Ensure deterministic behavior of the algorithm by incorporating a
random_stateparameter. - Analysis: Provide a detailed analysis of the time and space complexity of your implementation, expressed in terms of
n(number of samples),d(number of dimensions), andk(number of clusters). - Testing & Diagnosis: Explain your approach to testing the correctness of the implementation (e.g., using simple 2D synthetic datasets like blobs) and how you would diagnose common convergence issues (e.g., when the cluster inertia fails to decrease monotonically).
Deliverables
- The complete function signature.
- A comprehensive docstring for the function.
- Well-commented Python code implementing the
kmeansfunction.
